Abstract Summary

Modern AI has achieved remarkable milestones in mathematics, successfully solving challenging problems paired with machine-checkable proofs (such as in Lean). However, these systems traditionally rely on pre-existing mathematical definitions and formal specifications. This introduces a fundamental question: Can an AI agent rigorously reason about an entirely unknown world?

This paper introduces the Algebraic World Model (AWM), a novel framework that bridges the gap between active environment exploration and explicit, formal mathematical reasoning.

Key Innovations of AWM:

  1. Interactive Exploration & Hypothesis Testing: AWM actively explores unfamiliar environments, iteratively building, testing, and refining executable Python hypotheses based on real-time observations.
  2. Structural Formalization: It organizes these hypotheses into typed objects and shared rules, subsequently simplifying them using category-theory-guided transformations.
  3. Rigorous Proof Generation in Lean 4: The streamlined model is formalized within Lean 4 to prove strict environment guarantees, such as reachability and logical impossibility.
  4. Surpassing LLM Baselines:
  5. On impossible game levels, AWM constructed closed, kernel-checked Lean proofs disproving every legal winning sequence in all six test runs. In contrast, baseline models equipped with coding tools (Claude Opus 5.5 and GPT-6 Astra) produced zero proofs across twelve equivalent runs.
  6. AWM correctly formulated 4 out of 6 initial bounds (compared to 1 for Opus 5.5 and 0 for GPT-6 Astra). When given feedback that a cheaper win existed, AWM successfully revised its rules and achieved 6 out of 6 correct bounds.
  7. Generalization on ARC-AGI-3: Across all 25 public ARC-AGI-3 games, AWM's interpretable models allowed Lean to successfully replay winning trajectories for all 183 levels. It generalized beyond observed play to predict unseen state transitions and detect sudden mechanics shifts. Paired with Claude Opus 5, AWM cleared all levels with a score of 99.9, utilizing only 43% of the human baseline's actions for certified winning trajectories.
